KNN Common Mistakes and Best Practices

1. Defining distance accidentally

Features with large numeric ranges can dominate Minkowski distance. Put scaling in the pipeline, but remember that equal variance is a modeling choice, not proof that every feature deserves equal influence. One-hot, ordinal, count, and continuous features may need different representations or a domain-specific metric.

2. Tuning kk on the test set

Choose kk, distance metric, neighbor weighting, and any dimensionality reduction within training folds. The test set is for one final estimate. Use group-aware or time-aware folds whenever observations are dependent.

from sklearn.datasets import load_wine
from sklearn.model_selection import GridSearchCV, train_test_split
from sklearn.neighbors import KNeighborsClassifier
from sklearn.pipeline import make_pipeline
from sklearn.preprocessing import StandardScaler

X, y = load_wine(return_X_y=True)
X_train, X_test, y_train, y_test = train_test_split(
X, y, test_size=0.25, stratify=y, random_state=42
)
pipeline = make_pipeline(StandardScaler(), KNeighborsClassifier())
search = GridSearchCV(
pipeline,
{
"kneighborsclassifier__n_neighbors": [3, 5, 9, 15],
"kneighborsclassifier__weights": ["uniform", "distance"],
"kneighborsclassifier__p": [1, 2],
},
cv=5,
)
search.fit(X_train, y_train)
print(search.best_params_)
print(f"Test accuracy: {search.score(X_test, y_test):.3f}")

3. Saying KNN cannot model nonlinear boundaries

KNN is a local, non-parametric method and can represent irregular nonlinear boundaries. The real limitations are finite-sample noise, the bias-variance choice in kk, the geometry induced by the metric, and sparse neighborhoods in high dimensions.

4. Fitting feature engineering globally

PCA, feature selection, imputation, and resampling are learned steps. Fitting them before cross-validation leaks validation-fold information. Place them before KNN inside the same pipeline. If oversampling is justified, use a fold-aware imbalanced-learning pipeline and apply it only to training folds.

5. Ignoring ties, imbalance, and calibration

Equal-distance neighbors with different labels can make results depend on training order. Odd kk reduces some binary vote ties but does not eliminate distance ties or multiclass ties. Class imbalance can dominate local votes; examine per-class metrics and consider distance weighting or a method designed for the cost structure. Neighbor vote fractions are not automatically calibrated probabilities.

6. Ignoring prediction cost

KNN stores the reference data and performs neighbor search for every query. Measure memory and latency using the fitted algorithm, dimensionality, and deployment batch size. Approximate search changes retrieval recall and should be validated separately from predictive quality.
